1 Join Probabilisic Daa Associaion-Feedback Paricle Filer for uliple Targe Tracking Applicaions Tao Yang, Geng Huang, Prashan G. eha arxiv:33.4v [ah.na 5 ar 3 Absrac This paper inroduces a novel feedback-conrol based paricle filer for he soluion of he filering proble wih daa associaion uncerainy. The paricle filer is referred o as he join probabilisic daa associaion-feedback paricle filer (JPDA-FPF). The JPDA-FPF is based on he feedback paricle filer inroduced in our earlier papers [7, [6. The rearkable conclusion of our paper is ha he JPDA-FPF algorih reains he innovaion error-based feedback srucure of he feedback paricle filer, even wih daa associaion uncerainy in he general nonlinear case. The heoreical resuls are illusraed wih he aid of wo nuerical exaple probles drawn fro uliple arge racking applicaions. I. INTRODUCTION Filering wih daa associaion uncerainy is iporan o a nuber of applicaions, including, air and issile defense syses, air raffic surveillance, weaher surveillance, ground apping, geophysical surveys, reoe sensing, auonoous navigaion and roboics [, [3. In each of hese applicaions, here exiss daa associaion uncerainy in he sense ha one can no assign individual easureens o individual arges in an apriori anner. Given he large nuber of applicaions, algorihs for filering probles wih daa associaion uncerainy have been exensively sudied in he pas; cf., [, [ and references herein. A ypical algorih is coprised of wo pars: (i) A filering algorih for racking a single arge, and (ii) A daa associaion algorih for associaing easureens o arges. Prior o id-99s, he priary ool for filering was a Kalan filer or one of is exensions, e.g., exended Kalan filer. The liiaions of hese ools in applicaions arise on accoun of nonlineariies, no only in dynaic oion of arges (e.g., drag forces in ballisic arges) bu also in he easureen odels (e.g., range or bearing). The nonlineariies can lead o a non-gaussian uliodal condiional disribuion. For such cases, Kalan and exended Kalan filers are known o perfor poorly; cf., [5. Since he adven and wide-spread use of paricle filers [7, [6, such filers are becoing increasing relevan o single and uliple arge racking applicaions; cf., [5 and references herein. Financial suppor fro he AFOSR gran FA and he NSF gran EECS is graefully acknowledged. T. Yang and P. G. eha are wih he Coordinaed Science Laboraory and he Deparen of echanical Science and Engineering a he Universiy of Illinois a Urbana-Chapaign (UIUC) aoyang@illinois.edu; ehapg@illinois.edu G. Huang is wih he Deparen of Elecrical and Copuer Engineering a UIUC huang5@illinois.edu The oher par is he daa associaion algorih. The purpose of he daa associaion algorih is o assign easureens o arges. The coplicaions arise due o uliple non-arge specific easureens (due o uliple arges in he coverage area), issing easureens (probabiliy of deecion less han one, e.g., due o arge occlusion), false alars (due o cluer) and apriori unknown nuber of arges (ha require rack iniiaion). The earlier soluions considered assignens in a deerinisic anner: These include he siple bu non-robus neares neighbor assignen algorih and he uliple hypohesis esing (HT) algorih, requiring exhausive enueraion [4, [3. However, exhausive enueraion leads o an NP-hard proble because nuber of associaions increases exponenially wih ie. The coplexiy issue led o developen of probabilisic approaches: These include he probabilisic HT or is sipler single-scan version, he join probabilisic daa associaion filer (JPDAF) [, [. The cenral objec of ineres in hese approaches is he copuaion (or approxiaion) of he easureen-o-arge associaion probabiliy. Cerain odeling assupions are necessary o copue hese in a racable fashion. Alhough he probabilisic algorihs have reduced copuaional coplexiy, hey have priarily been developed for linear seings; cf., [. The developen of paricle filers has naurally led o invesigaions of daa associaion algorihs based on iporance sapling echniques. This reains an acive area of research; cf., [ and references herein. One early conribuion is he uliarge paricle filer (PFT) in [8. The daa associaion proble is approached in he sae probabilisic spiri as he basic JPDAF. The associaion probabiliies are obained via he use of arkov Chain one-carlo (CC) echniques; see also [, [3 for relaed approaches. In his paper, we inroduce a novel feedback conrol-based paricle filer algorih for soluion of he join filering-daa associaion proble. The proposed algorih is based on he feedback paricle filer concep inroduced by us in earlier papers [7, [6. A feedback paricle filer is a conrolled syse o approxiae he soluion of he nonlinear filering proble. The filer has a feedback srucure siilar o he Kalan filer: A each ie, he conrol is obained by using a proporional gain feedback wih respec o a cerain odified for of he innovaion error. The filer design aouns o design of he proporional gain he soluion is given by he Kalan gain in he linear Gaussian case. In he presen paper, we exend he feedback paricle filer o probles wih daa associaion uncerainy. We refer
2 o he resuling algorih as he join probabilisic daa associaion-feedback paricle filer (JPDA-FPF). As he nae suggess, he proposed algorih represens a generalizaion of he Kalan filer-based join probabilisic daa associaion (JPDAF) now o he general nonlinear filering proble. One rearkable conclusion of our paper is ha he JPDA- FPF reains he innovaion error-based feedback srucure even for he nonlinear proble. The innovaion error-based feedback srucure is expeced o be useful because of he coupled naure of filering and he daa associaion probles. The heoreical resuls are illusraed wih wo nuerical exaples. The firs exaple considers he proble of racking a single arge in he presence of cluer. The second exaple considers a uliple arge racking proble. The odel proble scenario is used o illusrae he perforance of JPDA-FPF vis-a-vis possible rack coalescence in he presence of daa associaion uncerainy [4. The ouline of his paper is as follows: The JPDA-FPF algorih is firs described for single arge in he presence of cluer, in Sec. II. The uliple arge case follows as a direc exension, and is discussed in Sec. III. Nuerical exaples appear in Sec. IV. The heory of feedback paricle filer can be found in our earlier papers [7,[6. In he reainder of his paper, we resric ourselves o he scalar filering proble. The scalar case serves he pedagogical purpose, and is noaionally convenien. The exension o he ulivariable case is sraighforward: The feedback paricle filer has he sae innovaion error-based srucure excep ha he gain funcion is replaced by he gain vecor. The ulivariable feedback paricle filer is used in he wo nuerical exaples described in Sec. IV. II. FEEDBACK PARTICLE FILTER WITH DATA ASSOCIATION UNCERTAINTY In his secion, we describe he probabilisic daa associaion-feedback paricle filer (PDA-FPF) for he proble of filering a single arge wih uliple easureens. The filer for uliple independen arges is obained as a sraighforward exension, and briefly described in Sec. III. A. Proble saeen, Assupions and Noaion The following noaion is adoped: (i) A ie, he arge sae is denoed by X R. (ii) A ie, he observaion vecor Z := (Z,Z,...,Z ) T, where is assued fixed and Z R. (iii) A ie, he associaion rando variable is denoed as A {,,...,}. I is used o associae one easureen o he arge: A = signifies ha he h -easureen Z is associaed wih he arge, and A = eans ha he arge is no deeced a ie. The following odels are assued for he hree sochasic processes: (i) The sae X evolves according o a nonlinear SDE: dx = a(x )d+ σ B db, () where a( ) is a C funcion and {B } is a sandard Wiener process. (ii) The associaion rando process A evolves as a jup arkov process in coninuous-ie: P(A +δ = A = )= c δ + o(δ),. () The iniial disribuion P([A = )= +. A and X are assued o be uually independen. (iii) A ie, he observaion odel is given by, dz = [A =h(x )d+ σ W dw, (3) for {,...,}, where h( ) is C funcion and {W } are uually independen sandard Wiener processes and { when A = [A = := oherwise. The proble is o obain he poserior disribuion of X given he hisory of observaions Z := σ(z s : s ). The ehodology coprises of he following wo pars: (i) Evaluaion of associaion probabiliy, and (ii) Inegraion of associaion probabiliy in he feedback paricle filer fraework. B. Associaion Probabiliy for a Single Targe The associaion probabiliy is defined as he probabiliy of he associaion [A = condiioned on Z : β P([A = Z ), =,,...,. (4) Since he evens are uually exclusive and exhausive, = β =. For he single-arge-uliple-observaion odel described above, he filer for copuing associaion probabiliy is derived in Appendix A. I is of he following for: For {,...,}, dβ = c [ (+)β d + σ W β ĥ β j + β (ĥ ĥ) [ (dz β ĥ d) (dz j β j ĥ d) β j (β j β )d, (5) where ĥ = E[h(X ) Z and ĥ = E[h (X ) Z. These are approxiaed by using he feedback paricle filer described in he following secion. In pracice, one ay also wish o consider approaches o reduce filer coplexiy, e.g., by assigning gaing regions for he easureens; cf., Sec in [. Reark : In he following, we inegrae associaion probabiliy wih he feedback paricle filer, which is used o approxiae evoluion of he poserior. Separae algorihs for daa associaion and poserior are oivaed in par by he classical JPDA filering lieraure [, [, [. A separae reaen is also useful while considering uliple arge racking probles. For such probles, one can exend algorihs for daa associaion in a sraighforward anner,
3 while he algorih for poserior reains as before. This is illusraed wih he aid of wo-arge-wo-observaion exaple in Sec III. Reark : The associaion probabiliy filer (5) can also be derived by considering a coninuous-ie lii saring fro he coninuous-discree ie filer in lieraure [. This proof appears in Appendix D. The alernae proof is included for he following reasons: (i) The proof shows ha he filer (5) is in fac he coninuous-ie nonlinear counerpar of he algorih ha is used o obain associaion probabiliy in he classical JPDAF filer. This is iporan because soe of he odeling assupions (e.g., odeling of cluer, or of associaion A via a jup arkov process) here ay appear o be differen fro hose considered in he classical lieraure. (ii) The proof ehod suggess alernae discree-ie algorihs for evaluaing associaion probabiliies in siulaions and experiens, where observaions are ade a discree sapling ies. C. Probabilisic Daa Associaion-Feedback Paricle Filer Following he feedback paricle filer ehodology, he odel for he paricle filer is given by, dx i = a(x i )d+ σ B db i + du i, (6) where X i R is he sae for he i h paricle a ie, U i is is conrol inpu, and {B} i are uually independen sandard Wiener processes. We assue he iniial condiions {X i}n i= are i.i.d., independen of {Bi }, and drawn fro he iniial disribuion p (x,) of X. Boh {B} i and {X i} are also assued o be independen of X,Z. Cerain addiional assupions are ade regarding adissible fors of conrol inpu (see [6). Recall ha here are wo ypes of condiional disribuions of ineres in our analysis: (i) p(x,): Defines he condiional dis. of X i given Z. (ii) p (x,): Defines he condiional dis. of X given Z. The conrol proble is o choose he conrol inpu U i so ha p approxiaes p, and consequenly epirical disribuion of he paricles approxiaes p for large nuber of paricles. The evoluion of p (x,) is described by odified for of he Kushner-Sraonovich (K-S) equaion: dp = L p d+ β (h ĥ )(dz ĥ d)p. (7) = where ĥ = h(x)p (x,)dx, and L is he Kologorov forward operaor. The proof appears in Appendix B. The ain resul of his secion is o describe an explici forula for he opial conrol inpu, and deonsrae ha under general condiions we obain an exac ach: p= p under opial conrol. The opially conrolled dynaics of he i h paricle have he following for, dx i = a(x i )d+σ B db i + β K(X i,)dii, = where I i, + σ W = (β ) K(X,)K i (X,)d, i (8) is a odified for of he innovaion process, := dz [ β h(x i )+( β )ĥ d, (9) di i, where ĥ :=E[h(X ) Z = h(x)p(x,)dx. The gain funcion K is he soluion of a cerain EL-BVP: ( ) x p(x, ) x {p(x,)k(x,)} = h (x), () The evoluion of p(x,) is easily obained as he forward Kologorov operaor: See Appendix B for he equaions. The following heore shows ha he wo evoluion equaions for p and p are idenical. The proof appears in Appendix B. Theore : Consider he wo evoluions for p and p, defined according o he Kologorov forward equaion and odified K-S equaion (7), respecively. Suppose ha he gain funcion K(X, ) is obained according o (). Then provided p(x,)= p (x,), we have for all, p(x,)= p (x,). Exaple : Consider he single arge, single easureen case where he easureen ay be due o cluer (false alar). Le β denoe he easureen-o-arge associaion probabiliy a ie. For his case, he feedback paricle filer is given by he conrolled syse which is a special case of (8), dx i = a(x i )d+ σ B db i + β K(X i,)dii + β K(X i,)k (X i,)d, () where he innovaion error I i is given by, ( di i β := dz h(x )+( i β ) )ĥ d. () For he wo exree values of β, he filer reduces o he known for: (i) If β =, he easureen is associaed wih he arge wih probabiliy. In his case, he filer is he sae as FPF presened in [6. (ii) If β =, he easureen carries no inforaion and he conrol inpu du i =. For β (,), he conrol is ore ineresing. The rearkable fac is ha he innovaion error-based feedback conrol srucure is preserved. The associaion probabiliy serves o odify he forulae for he gain funcion and he innovaion error: (i) The gain funcion is effecively reduced o β K(X i,). Tha is, he conrol ges less agressive in he presence of possible false alars due o cluer.
4 (ii) The innovaion error is given by a ore general forula (). The opial predicion of he i h -paricle is now a weighed average of h(x) i and he populaion predicion ĥ N N h(x j ). Effecively, in he presence of possible false alars, a paricle gives ore weigh o he populaion in copuing is innovaion error. D. Exaple: Linear Case We provide here a special case of PDA-FPF for he single arge racking proble described by a linear odel: dx = α X d+ σ B db, dz = γ X d+ σ W dw, (3a) (3b) where α,γ are real nubers. The PDA-FPF is described by (8) (). If we assue p(x,) o be Gaussian a each ie wih ean µ and variance Σ, i.e., p(x,)= πσ exp( (x µ ) Σ ), hen by direc subsiuion in () we obain he gain funcion: dβ The PDA-FPF is hen given by, dx i = α X i + γσ σ W d+ σ B db i β = K(x,)= γσ. (4) [dz γ( β X i +( β The filer for associaion probabiliy β = c [ (+)β d + β [ γµ β j (dz )µ )d. is as follows: (5) β γµ d) (dz j β j γµ d) + β γ Σ β j (β j β )d, (6) In pracice {µ,σ } in (5)-(6) are approxiaed as saple eans and saple covariances using {X i } N i=. µ µ (N) := N N i= Σ Σ (N) := N X i, N i= (X i ). µ(n) III. ULTIPLE TARGET TRACKING USING FEEDBACK PARTICLE FILTER (7) In his secion, we exend he PDA-FPF o uliple arge racking probles. Specifically, a wo-arge wo-observaion proble is used o illusrae JPDA-FPF. The exension o he ore general case is sraighforward. A. Proble saeen The following noaion is adoped: (i) A ie, he arge sae is denoed as X :=(X,X ) T, where X n R for n {,}. (ii) A ie, he observaion vecor Z :=(Z,Z )T, where Z R for {,}. (iii) A ie, he associaion rando variable is denoed as A {,}. I is used o associae easureens o arges in a join anner: A = signifies ha Z is associaed wih arge and Z wih arge. Siilarly A = accouns for he copleenary case. The following odels are assued for he hree sochasic processes: (i) Each eleen of he sae vecor X evolves according o a one-diensional nonlinear SDE: dx n = a(x n )d+ σ n B db n, n {,} (8) where {B },{B } are uually independen sandard Wiener processes. (ii) The associaion rando process A evolves as a jup arkov process in coninuous-ie: P(A +δ = A = )=cδ + o(δ),. (9) The iniial disribuion P([A = ) =. A and X are assued o be uually independen. (iii) A ie, he observaion odel is given by, [ h(x [ dz dz = Ψ(A ) ) h(x ) [ dw d+ σ W dw, () where {W },{W } are uually independen sandard Wiener processes and Ψ(A ) is a funcion which aps A o a peruaion arix: [ [ Ψ()=, Ψ() =. () B. Join Probabilisic Daa Associaion for Two Targe The join associaion probabiliy is defined as he probabiliy of he join associaion [A = condiioned on Z : π P([A = Z ), =,. () The filer for join associaion probabiliy π is a sraighforward exension of (5). The proof appears in Appendix C. I is of he following for: dπ = c(π π )d+ π π (ĥ ĥ )(dµ dµ ) π π (π π )[ (h ) (ĥ ) + (h ) ((ĥ ) d, (3) where dµ = dz (π π )ĥ d, ĥ n :=E[h(X n) Z and (h ) n := E[h (X n) Z. Since he join evens are uually exclusive and exhausive, we have = π =. Using his, we have π = π and dπ = dπ.

Daa Associaion-Feedback Paricle Filer The join associaion probabiliies π,π are used o obain arginal associaion probabiliy for individual arge. For exaple, for arge : β = π, β = π. Once he associaion probabiliies are known, he feedback paricle filer for each arge is of he for (8). IV. NUERICS In his secion, we discuss resuls of wo nuerical exaples. Even hough he heory was described for real-valued sae and observaion processes, he nuerical exaples consider ore realisic ulivariable odels. A. Single Targe Tracking in Cluer We firs consider a single arge racking proble where he arge dynaics evolve according o a whie-noise acceleraion odel: dx = FX d+ σ B db, (4) dz = HX d+ σ W dw, (5) where X denoes he sae vecor coprising of posiion and velociy coordinaes a ie, Z is he observaion process, {B },{W } are uually independen sandard Wiener processes. The wo arices are given by: [ F =, H = [. (6) In he siulaion resuls described nex, we use he following paraeer values: σ B =[;, σ W =.6 and iniial condiion X =[;6. The oal siulaion ie is T = and ie sep d =.. A each discree-ie sep, we assue = 4 easureens, one due o arge and oher hree due o cluer. The associaions are no apriori known. Figure depics he resul of a single siulaion: True arge rajecory is depiced as a dashed line. A each discree ie sep, arge-oriened easureens are depiced as circles while cluer easureens are depiced as squares. The esiaed ean rajecory is depiced as a solid line. I is obained using he PDA-FPF algorih described in Sec II- D. For he filer siulaion, we use N = paricles. B. Track Coalescence Avoidance using JPDA-FPF Track coalescence is a coon proble in uliple racking applicaions. Track coalescence can occur when wo closely spaced arges ove wih approxiaely he sae velociy over a ie period [3. Wih sandard ipleenaions of JPDAF and SIR paricle filer algorihs, he arge racks ends o coalesce even afer he arges have oved apar [4. In he following exaple, we describe siulaion resuls for JPDA-FPF for a odel proble scenario aken fro [5. We consider wo arges. For each arge, he dynaics are described by a whie-noise acceleraion odel as in he preceding exaple. For n=,: dz dx n = FX n d+ σ B db, (7) where he sae X n coprises of arge posiion and velociy. We assue wo observaions are given by [ [ [ dz HX = Ψ(A ) dw HX d+ σ W dw, (8) where A is he associaion rando variable, Ψ(A ) is he peruaion arix as defined in (). {B },{W },{W } are uually independen sandard Winer processes. In he siulaion resuls described nex, we use he following paraeer values: σ B =[;, σ W =[.5;.5 and iniial condiion X =[; 3.5; ;3.5. The oal siulaion ie is T = s and ie sep d =.s. The prior associaion probabiliy (π,π ) is assued o be (/,/). Figure (a) depics he resuls of a single siulaion: The esiaed ean rajecories are obained using he JPDA- FPF described in Sec III. Figure (b) depics he evoluion of associaion probabiliy (π,π ) during he sae siulaion run. For he filer siulaion, we use N = paricles. To obain he associaion probabiliies, we use an adapive ie sepping schee for nuerical inegraion of associaion probabiliy filer (3). ACKNOWLEDGEENT We are graeful o Prof. Sean eyn for useful discussions on he work described in his paper. APPENDIX A. Associaion Probabiliy Filer for β Rewrie (3) in he vecor for: dz = χ(a )h(x )d+ σ W dw, (9) where χ(a ) := (χ,..., χ ) T, χ = [A =, and W := (W,...,W ) T. The ransiion inensiy arix for he jup arkov process A is denoed as Λ wih { c if = Λ = c/ if (3). Denoe X := σ(x s : s ), and C := X Z. The derivaion is based on he propery of he condiional expecaion: E[ϕ(A ) Z =E[E[ϕ(A ) C Z.

The SDE for evoluion of E[ϕ(A ) C is described by he sandard Wonha filer: E[ϕ(A ) C =E[ϕ(A )+ + = E[Λϕ(A s ) C s ds E[(D s h(x s)β s I)ϕ(A s) C s (dz s h(x s)β s ds), (3) where I is he ideniy arix, D is he diagonal arix where he only non-zero enry is (D ) = h(x ). Taking E[ Z of (3) gives he desired resul (5). B. Consisency proof of p and p Evoluion equaion for p : Recall Z := σ(z s : s ), A := σ(a s : s ). We denoe C := A Z. The derivaion is based on he propery of he condiional expecaion: E[ϕ(X ) Z =E[E[ϕ(X ) C Z. The sde for evoluion ofe[ϕ(x ) C is described by he sandard nonlinear filer wih innovaion error, = χ (dz ĥ d), where χ = [A =: E[ϕ(X ) C =E[ϕ(X )+ + = E[L ϕ(x s ) C s ds E[(h ĥ s )ϕ(x s ) C s χ s (dz s ĥ s ds), where L denoes he Kologorov s backward operaor for he diffusion () (he adjoin of L ). Taking E[ Z gives he desired resul because E[χ s Z s=p([a s = Z s )=β s. Evoluion equaion for p: We express he FPF (8) as: dx i = a(x i )d+ σ B db i +K(X i,) β dz + u(x i,)d, = where u(x,) := = + σ W [ β β h+( β )ĥ K(x, ) (β ) KK (x,). (3) The evoluion equaion for p now follows: dp=l pd x (up)d+ σ W (β ) ( pk ) x d x (Kp) β dz. (33) = Proof of consisency. The proof follows closely he consisency proof for he feedback paricle filer (see Appendix C in [6). If K solves he E-L BVP hen x (Kp)= (h ĥ )p (34) On uliplying boh sides of (3) by p and siplifying (by using (34)), we obain up= σ W x (pk ) = (β ) +Kp = β ĥ Differeniae now boh sides wih respec o x and use (34) once again o arrive a = (β ) ( pk ) x (up)= x (h ĥ )p β ĥ. (35) Using (34) and (35) in he forward equaion (33), we obain: dp=l pd+ σ W This is precisely he SDE (7), as desired. β (h ĥ )(dz ĥ d)p (36) C. Associaion Probabiliy filer for π The derivaion follows closely he derivaion in Appendix A. Noe ha he observaion odel is described by (). Denoe h(x ) := (h(x ),h(x ))T, Ψ := = π Ψ() and φ =(φ,φ )T := Ψ h(x ). The Wonha filer is given by: E[ϕ(A ) C =E[ϕ(A )+ + = E[Λϕ(A s ) C s ds E[(D s φ s I)ϕ(A s) C s (dzs φ s ds), (37)

Alernae Derivaion of (5) The ai of his secion is o derive, forally, he updae par of he coninuous ie filer (5) by aking a coninuous ie lii of he discree-ie algorih for evaluaion of associaion probabiliy. The procedure for aking he lii is siilar o Sec 6.8 in [9 for derivaion of he K-S equaion. A ie, we have easureens dz = (dz, dz,..., dz ) T, only one of which originaes fro he arge. The discree-ie filer for associaion probabiliy is obained by using Bayes rule (see [): P([A = Z, dz )= P(dZ [A = )P([A = Z ) P(dZ [A = j)p([a = j Z ). (38) In evaluaion of he associaion probabiliy, one ypically assues a cluer odel whereby he independen easureens are uniforly and independenly disribued in he coverage area V ([,[). We hen have: P(dZ [A = )= V P(dZ [A = ) = V L(dZ ). (39) where L(dZ [ )= πσ W d R exp (dz h(x)d) d p(x,)dx. Now, denoe β =P([A = Z ), he increen in he easureen updae sep (see Sec 6.8 in [9) is given by dβ :=P([A = Z, dz ) P([A = Z ). (4) Using (38) and (4), we have: where dβ = E (d, dz )β β, (4) E (d, dz )= P([A = Z, dz ). (4) P([A = Z ) We expand E (d, dz ) as a ulivariae series abou (,): E (d, dz )=E (,)+E d (,)d+ E dz j (,)dz j + By direc evaluaion, we obain: E dz j (,)dz j,k=,dzk j dz k + o(d). (43) E (,)=, E d (,)=, E dz j (,)= β j ĥ, j E dz E dz j,dz j E dz,dz (,)= ( β )ĥ, (,)= 4 β j (β j )ĥ, j (,)= 4 ( β )( β )ĥ, where ĥ :=E[h(X ) Z and ĥ :=E[h (X ) Z. By using Iô s rules, This gives dz j dz k = { σ W d, if j = k,, oherwise. E (d, dz )=+ ĥ β j (dz + h dz j ) β j (β j β )d, (44) Subsiuing (44) o (4) we oain he expression for dβ which equals he easureen updae par of he coninuousie filer (5). Reark 3: During a discree-ie ipleenaion, one can use (38)-(39) o obain associaion probabiliy.
